Gradient-Diff Steering for Behavior Editing in Small LMs
A very early research update describing two experiments I've run using gradient- and weight-based methods to localize behaviors acquired by finetuning within the diff.

Model: Llama-3.2-1B-Instruct
Objective: to test whether a simple gradient-based attribution technique can decompose a finetuning “diff” into behavior-specific directions in weight-space that we can then add to (or subtract from) the weights to attenuate or amplify targeted behaviors. The longer-term motivation is to move toward systematic analyses of what, exactly, is learned in the finetuning diff and how such structure can be used for steering and removal of undesired behaviors.
Method
I use a simple, first-order attribution scheme. Let $\theta$ denote model parameters and $L(\theta; x_{1:T})$ the standard causal-LM cross-entropy on a tokenized response $x_{1:T}$ under teacher forcing. For a pile of examples $\mathcal{D}={(p,r)}$ consisting of prompts $p$ and their associated assistant responses $r$, I compute the pile-average gradient by backpropagating the training loss on the observed responses and averaging across response tokens $t \in T$ and across examples in the pile:

For topics experiments I apply assistant-only loss masking (user tokens are labeled −100-100 so they do not contribute to the loss); for the harmfulness experiment I use the full loss because the public datasets I used were not ideally suited to the goals of the experiment.

From pile-average gradients I construct steering vectors $V$ (with $V$ to emphasize “vector”, i.e. steering vector in weight-space). I then steer the anchor weights by adding or subtracting a small multiple of $V$: $$\theta_{\text{steered}} \;=\; \theta_{\text{anchor}} \;\pm\; \alpha\, V.$$
Convention. Positive steering reduces the targeted behavior. Concretely, adding $+\alpha V$ decreases the behavior and subtracting $-\alpha V$ increases it. Intuitively, $\nabla L$ points toward higher loss on behavior-specific tokens; moving with this gradient pushes the model away from producing them.
Finally, I explore an element-wise weighting that ties steering to where the finetune actually changed parameters. I call this absolute Hadamard diff weighting:
$$V^{(\Delta)} \;=\; \left(\frac{|\Delta|}{s}\right) \odot V,$$where $\odot$ is the element-wise product and $s$ is a global scale chosen from the tail of the $|\Delta|$ distribution so that magnitudes remain comparable to unweighted steering. In the runs below I used a high percentile statistic (97th) of $|\Delta|$ as a proxy for the “median of active weights” in the changed-weights cluster; a more principled scaling (e.g., true median/mean of the active tail) is straightforward future work. 1
Experiment 1 — Harmfulness Steering
Setup. I finetuned Llama-3.2-1B-Instruct on a public “toxic” chat dataset. I tried this using lmsys/toxic-chat
and dvruette/toxic-completions
(train splits only) as that dataset and achieved similar results. The evaluation prompts came from allenai/real-toxicity-prompts
(non-challenging subset). A GPT-4o-mini judge provided binary harmfulness ratings; I used the same judge, prompt pool, and sampling settings for all conditions. From these eval generations I formed two piles on the anchor model: HARMFUL (prompts whose anchor responses were judged harmful) and HARMLESS (prompts where both the un-finetuned and finetuned models were harmless). I computed $V_{\text{harm}}$ on the anchor and steered with $\alpha=0.00075$.
Anchor behavior. Finetuning raised the harmfulness rate from approximately 1% to 4–6% depending on dataset and training hyperparameters.
Steering outcomes. Subsequently, after computing $V_{\text{harm}}$, - Adding the positive steering vector ($+\alpha V_{\text{harm}}$) reduced harmfulness back to ≈1% - Adding negative steering instead ($-\alpha V_{\text{harm}}$) increased harmfulness to ≈15–18%.2 - Applying absolute Hadamard diff weighting yielded qualitatively similar behavior, though the effect size at the same $\alpha$ was somewhat smaller due to inexact scaling as mentioned above.

Experiment 2 — Topic-Based Steering
After getting initial signal that the pile-average gradient might be useful for steering, I wanted to see if I could get more fine-grained control using a finetune that taught multiple behaviors. Instead of distinguishing between harmful and not harmful, I used responses that were Golden Gate Bridge-related (in the spirit of Anthropic's original SAEs work), recipe-related, and neither.
Setup. I constructed a small single-turn dataset (136 examples) with Claude 4 Sonnet in which half of the assistant replies inappropriately mention the Golden Gate Bridge and half inappropriately mention recipes/cooking, on queries that are not bridge or recipe-related;3 the two types were randomly interleaved during training. I finetuned Llama-3.2-1B-Instruct with assistant-only loss masking. For evaluation, I used 100 random generic prompts, also Claude-generated and distinct from the finetune data. Presence labels were produced by a hybrid judge: high-precision heuristics first (e.g. "has the word Golden Gate Bridge in response"), and otherwise a GPT-4o-mini JSON judge returning booleans ${\text{bridge},\text{recipe}}$. From the anchor’s eval generations I formed BRIDGE, RECIPE, and NEITHER piles (ignoring BOTH because it never occurred, interestingly). I computed $V_{\text{bridge}}$ and $V_{\text{recipe}}$ and steered the anchor with $\alpha=0.00075$.
Anchor behavior. After finetuning, the anchor mentioned the bridge in 56% of responses and recipes in 14% (the un-finetuned Instruct model sat near 0% bridge and 2% recipe under the same evaluation). It is potentially worth exploring further why this occurs despite equal representation in the training set; my guess is that this is the fact that the finetune for Golden Gate is concentrated in only a couple tokens, whereas there is a much larger number of words that can be associated with recipes meaning that finetune probability changes are less visible because they are more distributed across tokens.
Steering outcomes.
- Bridge direction: negative steering (expected to increase bridge) produced 77% bridge / 11% recipe with the remainder neither; positive steering (expected to reduce bridge) produced 21% / 14%.
- Recipe direction: negative steering (increase recipe) produced 34% / 34% (bridge/recipe); positive steering (reduce recipe) produced 69% / 5%.

Absolute Hadamard diff weighting reproduced the same qualitative pattern; again, the magnitude of the effect was somewhat smaller at identical $\alpha$ because the crude tail-based rescaling under-normalizes in some layers.

Layerwise visualizations of $\lVert V\rVert$ on the harmful experiment exhibit a pronounced spike in Layer 1. A potential hypothesis—consistent with some prior observations in refusal/harmlessness work—is that refusal is mediated by early layers, and thus a harmful finetune includes significant changes reducing the prevalence of refusals. This of course is not the full story, since the harmful model tends towards harmful responses even on ostensibly harmless prompts. Also, there is some strong evidence against this hypothesis, particularly that the finetune's diff does not show a spike, meaning that parameters in layer 1 have been modified approximately as much as other layers'.

Practical Notes
The finetunes and all steering experiments were run on a single A100 40 GB GPU. Training for the topics experiment used standard Hugging Face defaults with gradient checkpointing enabled and a learning rate of $55\times 10^{-5}$ the harmfulness finetunes used similar settings but did not employ assistant-only masking due to dataset quality. Steering strength was kept fixed at $\alpha=0.00075$ across conditions unless otherwise noted.
For attribution, I accumulated gradients over all parameters rather than restricting to late layers or MLPs; this choice is deliberately conservative for a first pass and keeps the procedure architecture-agnostic. Future experiments may explore limiting gradients to certain layers, e.g. only layer 1, or all layers but layer 1. For generation, I used left-padding at decode time (to avoid decoder-only padding pathologies) and otherwise standard sampling parameters; evaluation judges were consistent across conditions (GPT-4o-mini and heuristics if applicable). Normalization followed the model’s built-in cross-entropy averaging over non-masked tokens and batches; there was no additional per-example length renormalization beyond that.
Limitations
The harmfulness datasets employed here are not ideal for eliciting the specific behaviors I care about, and real-toxicity-prompts
is likewise not perfectly matched to the steering target.
Beyond that, these experiments intentionally amplify stylized behaviors (e.g., comically overt topic insertion) in order to get signal; they are not a realistic deployment setting. I have not yet measured coherence/perplexity or refusal rate trade-offs under steering, which could confound judge outcomes (e.g., a reduction in capability that superficially “fixes” behavior), though I checked subjectively to make sure the steered responses were not highly incoherent. (There was some loss of coherence, mainly getting into loops e.g. "[sentence 1]. [sentence 1]. [sentence 1]" but only on occasional prompts, and the rater rated them harmful only when they indeed contained harmful content.) Finally, gradient attributions are known to be noisy and non-causal in general (see concerns with APD mentioned in SPD, page 2); the present results should be interpreted as pragmatic, first-order probes rather than identifications of mechanistic causes.
What Comes Next
There are several straightforward ways to refine both attribution and projection. On the attribution side, replacing raw cross-entropy with KL-divergence to a reference distribution could provide a sharper directional signal (or dilute it; this is an empirical question). More broadly, it would be useful to take inspiration from attribution-based parameter decomposition (APD) and stochastic parameter decomposition (SPD) techniques, particular stochastic masking to approximate causal importances. On the projection side, the absolute Hadamard diff weighting used here is a deliberately simple surrogate and is not in fact an actual projection; a more principled projection onto the subspace spanned by the diff (or its low-rank approximation) may yield different results, though if they did it would be somewhat surprising.
A second line of work concerns understanding the structure of the diff itself. I plan to profile the distribution of $|\Delta|$ for the topics finetune and check whether the Layer 1 spike in $\lVert V\rVert$ replicates; if it does, that might suggest that something in the pile-average gradient technique concentrates attributions in layer 1, though it could certainly be evidence for something else. I also want to examine sign-restricted variants (e.g., positive-only portions of $V$ or $\Delta$) and test portability by applying learned directions to the un-finetuned Instruct model. Positive results reusing the finetune's steering vectors on the instruct model would suggest that these finetunes are simply amplifying existing circuits/mechanisms rather than meaningfully changing them, which would provide interesting insight into the model's internals. Finally, to evaluate practical utility, I will move to a more realistic harmfulness dataset (e.g., LLM-LAT/harmful-dataset
) and add basic coherence metrics so that changes in behavior can be cleanly separated from changes in capability.
A third line involves scaling and robustness. Rather than explicitly training for an exaggerated behavior, I can simulate dataset poisoning or subtler finetunes where the target behavior occupies only a small slice of the overall diff. This would test whether gradient-diff steering remains effective when signal is sparse and whether low-rank approximations of $V$ can reduce noise while preserving effect size.
